The Hidden Cost of Unvalidated AI in Supply Chain
In 2025, I was brought in to support a major automotive manufacturer’s supply chain AI program. The mandate was straightforward — deploy AI-powered tools across procurement, warranty analytics, and plant operations. The business case was compelling. The models were sophisticated. The data pipelines were a disaster.
Nobody had validated them.
This is not an unusual story. Across US manufacturing, logistics, and distribution, organizations are deploying AI at speed. What they are not doing, in most cases, is asking the question that determines whether any of it actually works: is the data feeding these models accurate, complete, and trustworthy?
When an AI system produces a wrong output, the instinct is to blame the model. In my experience across more than two decades working with enterprise data systems — from warehouse management to ERP to ML platforms — the model is rarely the problem. The data is the problem.
At one engagement, procurement buyers were spending tens of thousands of hours annually on manual forecasting because the AI tool built to replace that work was producing outputs nobody trusted. Not because the algorithm was wrong. Because the data pipelines feeding it were pulling stale cost data that had not been refreshed in weeks. The model was doing exactly what it was designed to do. It just had no idea the inputs were wrong.

Gartner estimates that poor data quality costs US organizations an average of $12.9 million per year. In supply chain specifically, a manufacturer deploying AI for predictive maintenance receives false alerts because sensor data was never validated for format consistency. A logistics provider using AI for demand forecasting produces wrong recommendations due to an undetected integration bug. In every case, the AI worked. The data did not.
The people who build AI models are not the same people who built the data pipelines. The data engineers who built the pipelines are not the same people who understand the business logic those pipelines represent. This is the gap that enterprise AI data governance exists to fill — sitting at the intersection of data architecture, integration logic, and business outcome, and asking whether the data is fit for the decision being made.
In one manufacturing engagement, governance was built into the delivery process itself — not as a separate audit but as a checkpoint at every stage. Data lineage was documented. Model assumptions were reviewed against actual pipeline behavior. Integration points were tested end-to-end. The result was a plant downtime AI application that delivered over a million dollars in annual savings in its first production deployment — because when it identified a problem, there actually was one.
